Bias in Algorithms and Data
One of the weakest aspects of predictive analytics is the presence of data bias and algorithmic bias. Predictive models use a large proportion of historical data for model construction. If this data reflects societal or institutional biases—such as against the race, gender, age, or economic status of individuals the model is likely to absorb and replicate such biases in prediction. Rather than providing unbiased information, such biased models can reinforce prevailing inequalities.
For example, in lending or employment, if previous records show biased preference for particular groups of individuals, the model can proceed to continue preferring such groups and discriminating against the rest. This leads to discriminatory results, such as denial of loans, jobs, or access to services based on biased patterns rather than real merit or need.
Bias can also result from algorithm design. If feature selection, model structure, or objective function includes implicit assumptions, it will bias towards specific results. Moreover, there is interpretation by human beings—developers and analysts can introduce bias in how they clean data, label categories, or define success.
Algorithmic bias calls for a multi-pronged approach to mitigate it. Data must be thoroughly audited for fairness and representativeness. Data reweighting, elimination of sensitive features, and application of fairness-aware machine learning techniques are some of the approaches that will help reduce bias. Model outputs must also be regularly monitored to detect and address any bias that may occur.
Lastly, making predictive analytics unbiased is both a technical issue and an ethical one. Companies must be vigilant so that they can stop biased systems from causing harm.
